Previous methods, relying on convolutional neural networks (CNNs) such as the well-known U-Net architecture, played a crucial role in image segmentation. They struggled to grasp the bigger picture, particularly when it came to global dependencies like illumination levels, scale variations, and occlusions. Attempts were made to patch these gaps, introducing techniques like dilated convolution and attention models. They often fell short of achieving comprehensive global dependencies, leading to potential declines in segmentation performance.

On the other hand, transformers, originally stars in natural language processing and computer vision, showcased exceptional long-range dependency capturing skills. However, their hierarchical nature sometimes hindered their ability to understand local contextual information, impacting the quality of segmentation outcomes. Attempts to meet the strengths of both CNNs and transformers were made that are TransFuse and MBT-Net. These hybrid models merged multi-level features, providing a more comprehensive representation of global context. However, integrating local representations into self-attention transformers remained a challenge, especially when dealing with small or indistinct objects with blurred boundaries.

Efforts were also made to preserve structure and size during segmentation, with UCTransNet employing multiscale channel-wise fusion with cross-attention. Microscopic Exploration: Unraveling Datasets and Models

Datasets

1. MoNuSeg Dataset: This dataset consists of 30 high-resolution training photos. Starting with H&E-stained cell images, each image has been manually annotated with around 22,000 nuclear borders. The 14 images that make up the test set canvas have more than 7,000 comments identifying nuclear boundaries. MoNuSeg tests segmentation technologies and requires a complicated approach due to changes in cell size and structure.

2. SegPC-2021 Dataset: This dataset, which is designed for the segmentation of multiple myeloma cells, consists of a training set with 290 samples, a validation set with 200 samples, and testing sets with 277 samples. A layer of complexity is added by the SegPC-2021 dataset, which offers a blank canvas for the segmentation of various cell types.

3. GlaS Dataset: It is a collection of high-resolution microscopic images taken from slides that had been stained with hematoxylin and eosin. There are 165 photos total in the dataset, with 85 being used for training and 80 for testing. In colon histology images, GlaS poses difficulties for gland segmentation, needing accurate segmentation skills.

4. ISIC-2018 Dataset: This dataset, which was assembled by the International Skin Imaging Collaboration, consists of 2594 dermoscopy images and their related ground truth annotations. The dermatological imaging problems introduced by ISIC-2018 call for the segmentation model to maneuver across a range of skin states.

5. ACDC Dataset: Housing 100 MRI scans, the ACDC dataset labels each scan for three different organs for example left ventricle (LV), right ventricle (RV), and myocardium (MYO). ACDC raises the stakes by introducing the complexity of multiple organs in the segmentation task. The below diagram shows how SA2-Net take inputs, encode it, decode it and then give output.

Models

1. SA2-Net Framework: SA2-Net sets an encoder-decoder framework. The encoder generates multi-scale features through four stages, striking a balance between efficiency and performance. The scale-aware attention (SA2) module captures shape and scale variations, while the adaptive up-attention (AuA) module refines features for precise segmentation. 

2. Scale-aware Attention (SA2) Module: Addressing the challenge of diverse shapes and sizes of cells, the SA2 module emerges as a novel solution. Multi-resolution features undergo local scale attention (LSA) for each stage, and global scale attention is introduced across all stages. LSA employs depthwise convolutional layers and a Sigmoid-activated attention mechanism to capture scale variations effectively. 

3. Adaptive Up-Attention (AuA) Module: In the decoder, traditional upsampling is replaced by the adaptive up-attention module (AuA). AuA not only upsamples features but introduces an attention mechanism for deep supervision. It captures salient features for the current stage, refining outputs and shaping the final segmentation mask. AuA tackles the challenge of suboptimal prediction masks, enriching each stage feature with salient information for accurate segmentation.

Examining the Scores: SA2-Net’s Standout Performance

It outperforms UCTransNet in dice scores for the GlaS and MoNuSeg datasets by 1.20 and 2.67%, respectively. The IoU metric confirms this success, with SA2-Net scoring impressively for GlaS and MoNuSeg with values of 84.90 and 68.70, respectively.It performs well in SegPC and defeats UCTransNet in the ISIC2018 dataset
